FinEvo: From Isolated Backtests to Ecological Market Games for Multi-Agent Financial Strategy Evolution
FinEvo introduces an ecological game formalism for evaluating multi-agent financial strategies, moving beyond isolated backtests to model trading strategies as adaptive agents interacting in a shared market. The framework integrates heterogeneous ML-based traders—rule-based, deep learning, reinforcement learning, and large language model agents—whose population evolves through three mechanisms: selection (based on forward-looking value estimates), innovation (Dirichlet-distributed mutation maintaining diversity), and environmental perturbation (stochastic shocks). The dynamics are formalized by the FinEvo stochastic differential equation, which unifies these forces and is shown to preserve simplex invariance, positivity, and existence/uniqueness under mild conditions. A macro-level variance decomposition attributes system volatility to the three mechanisms.
Experiments with artificial shocks and real-world news streams demonstrate that FinEvo reveals context-dependent outcomes: positive shocks increase diversity, negative shocks concentrate dominance, and intra-day dynamics exhibit multi-phase cycles of selection, innovation, and perturbation. Ablation studies confirm that selection drives efficiency, innovation sustains diversity, and perturbation enables adaptive reorganization. The framework also shows robustness to random seeds and parameter variations, and outperforms existing platforms like ABIDES and PyMarketSim in capturing dynamic, adaptive market evolution.
By reframing strategy evaluation as an ecological game, FinEvo provides a principled protocol for analyzing robustness, adaptation, and emergent dynamics in multi-agent financial markets. It offers a controlled environment to stress-test systemic risks and market shocks, and may serve as a tool for exploring the impact of macroeconomic policies and financial regulations on price evolution and equilibrium.
Highlights
- 1Introduces FinEvo, an ecological game formalism integrating heterogeneous ML-based traders with evolutionary population dynamics for financial strategy evaluation.
- 2Formalizes population evolution via the FinEvo SDE, unifying selection, innovation, and environmental perturbation into a single mechanism-level framework.
- 3Establishes minimal theoretical guarantees for the FinEvo SDE, including simplex invariance, positivity, and existence/uniqueness, along with a macro-level variance decomposition.
- 4Demonstrates through experiments with artificial shocks and real-world news that FinEvo reveals context-dependent performance, robustness, and emergent coalition dynamics invisible to static backtests.
- 5Provides a principled environment for studying systemic risks, market shocks, and the impact of macroeconomic policies on price evolution and equilibrium.
Methods
- MEcological game formalism with heterogeneous agents (rule-based, deep learning, reinforcement learning, LLM) interacting via continuous double auction.
- MFinEvo SDE modeling population dynamics through selection (replicator dynamics), innovation (Dirichlet-distributed mutation), and environmental perturbation (stochastic diffusion).
- MMonte Carlo simulation with 128 independent runs per configuration, analyzing micro (market share, win rate), meso (correlation networks, modularity), and macro (volatility decomposition, phase changes) metrics.
- MAblation studies removing each evolutionary pressure and sensitivity analysis on key parameters (β, μ, γ) and market size.
Results
- RPositive shocks increase diversity by reducing dominance of single strategies, while negative shocks reinforce concentration toward LLM-dominated equilibria.
- RVolatility decomposition shows shocks amplify perturbation short-term, but long-run equilibria are shaped by selection, with innovation maintaining diversity.
- RIntra-day dynamics follow multi-phase cycles: strong selection concentrates capital, innovation restores diversity, and perturbation near close disrupts alliances before new equilibrium emerges.
- RLLM-based agents consistently rank higher across bull and bear markets, indicating robustness from integrating diverse informational cues.
- RAblation confirms selection drives efficiency, innovation sustains diversity, and perturbation enables adaptive reorganization; removing any component leads to either fragmentation, oligopoly, or rigidity.
