S$^{3}$G: Stock State Space Graph for Enhanced Stock Trend Prediction
The paper introduces S3G (Stock State Space Graph), a novel framework for stock trend prediction that explicitly models the evolving interdependencies between stocks over time. Unlike prior methods that rely on static industry graphs or per-slice similarity measures, S3G employs a state space formulation over temporal graphs to capture both instantaneous and delayed interactions. The framework consists of two main components: a Wavelet Denoising Net (WDN) that uses discrete wavelet decomposition with learnable soft thresholding to denoise financial series and extract salient patterns, and a State Space Graph Learning (SSGL) module that constructs time-specific graphs via Gaussian kernel similarity on patch embeddings and models their evolution through parametric state space equations. The predicted graph structure is then aggregated using a graph neural network to produce cross-sectional return forecasts. The model is trained end-to-end with a dual objective combining MSE and ranking losses.
Extensive experiments on the Chinese CSI 500 index from 2015 to 2024 demonstrate that S3G achieves state-of-the-art performance across multiple metrics, including Information Coefficient (IC), RankIC, annualized return, and Sharpe ratio, outperforming 15 baselines ranging from traditional machine learning (XGBoost) to deep learning methods (LSTM, Transformer, Mamba) and specialized financial models (FactorVAE, MambaStock). Ablation studies confirm the critical importance of both the denoising and graph evolution components, as removing either leads to significant performance degradation. The results highlight the value of capturing fine-grained, time-varying stock relationships for enhanced predictive accuracy in financial markets.
Highlights
- 1Proposes S3G, a novel framework that models the evolution of inter-stock relationships over time using state space models on dynamic graphs.
- 2Introduces a Wavelet Denoising Net (WDN) to denoise financial series and extract salient patterns via learnable soft thresholding.
- 3Develops a State Space Graph Learning (SSGL) module that captures both instantaneous and time-lagged dependencies between stocks.
- 4Achieves state-of-the-art performance on CSI 500 data, with superior annualized returns and Sharpe ratios compared to 15 baselines.
- 5Ablation studies confirm the critical importance of both WDN and SSGL components for accurate stock trend prediction.
Methods
- MWavelet Denoising Net (WDN): applies discrete wavelet decomposition with learnable soft thresholding to denoise stock sequences.
- MState Space Graph Learning (SSGL): models temporal evolution of per-slice graphs via state space transition equations with learnable parameters.
- MGaussian kernel graph construction: builds time-specific adjacency matrices from patch embeddings.
- MDual-objective optimization: combines MSE loss and ranking loss with a scaling coefficient for training.
Results
- RS3G achieves the highest IC (0.041), ICIR (0.531), RankIC (0.074), RankICIR (0.892), ARR (0.247), ASR (1.336), and IR (0.040) on CSI 500.
- ROutperforms all baselines including XGBoost, LSTM, GRU, Transformer, Mamba, PatchTST, and FactorVAE across most metrics.
- RAblation without WDN drops IC from 0.041 to 0.019 and ARR from 0.247 to 0.163; without SSGL, IC drops to -0.077 and ARR to 0.105.
- RAchieves competitive risk metrics (AVol 0.185, MDD -0.136) while delivering the highest returns, balancing risk and return effectively.
- RDemonstrates the importance of modeling dynamic inter-stock relationships over static or per-slice graphs.
