This paper introduces SimLOB, a novel Transformer-based autoencoder designed to learn compact vectorized representations of Limit Order Book (LOB) data for financial market simulation (FMS) calibration. Unlike prior work that only uses mid-price data, SimLOB captures the full market microstructure by encoding LOB's high-dimensional, multi-scale, and precedence-constrained structure into a low-dimensional latent vector. The encoder consists of a fully connected network for feature extraction, a Transformer stack to model non-linear temporal dependencies, and another fully connected network for dimension reduction; the decoder is symmetric. The model is trained to minimize reconstruction error on LOB segments of 100 time steps.

Extensive experiments on synthetic data from the PGPS agent-based model and real stock data demonstrate that SimLOB significantly outperforms existing LOB-oriented neural networks (e.g., CNN+LSTM) in reconstruction quality. Crucially, when the learned latent representations are used as the calibration objective for FMS, they yield higher-fidelity simulations compared to traditional mid-price calibration or raw LOB inputs. Ablation studies confirm the importance of the Transformer and fully connected layers over convolutional alternatives. This work represents the first successful attempt to calibrate FMS using LOB data, enabling more accurate market simulations for anomaly detection and policy analysis.

Highlights

  • 1First work to calibrate financial market simulation (FMS) using limit order book (LOB) data instead of mid-price only.
  • 2Proposes SimLOB, a Transformer-based autoencoder to learn low-dimensional vectorized representations of LOB.
  • 3Addresses unique LOB challenges: non-linear temporal auto-correlation, price level precedence constraints, and multi-scale features.
  • 4Demonstrates that better LOB representations lead to improved FMS calibration performance.
  • 5Outperforms existing LOB-oriented neural networks (e.g., CNN+LSTM) in reconstruction and calibration tasks.

Methods

  • M
Transformer-based autoencoder with encoder and decoder each containing a fully connected network (FCN) for feature extraction, a Transformer stack for temporal modeling, and a dimension reduction FCN.
  • M
Training with reconstruction loss (MSE) on LOB segments of 100 time steps, using Adam optimizer.
  • M
Calibration of FMS (PGPS model) by minimizing discrepancy between latent representations of simulated and observed LOB.
  • M
Synthetic data generation using the Preis-Golke-Paul-Schneid (PGPS) agent-based model with varied parameters.

Results

  • R
SimLOB achieves significantly lower reconstruction error on synthetic LOB compared to eight baseline methods (e.g., CNN, LSTM, Transformer variants).
  • R
Calibration using SimLOB latent vectors yields better FMS fidelity than mid-price calibration or raw LOB inputs.
  • R
The learned latent representation preserves both temporal auto-correlation and price level precedence constraints.
  • R
Ablation studies show that removing the Transformer or using CNN instead of FCN degrades performance.
  • R
SimLOB generalizes to real stock data and synthetic data with different tick sizes and order types.
