QuantAgent: Price-Driven Multi-Agent LLMs for High-Frequency Trading
QuantAgent introduces a novel multi-agent LLM framework tailored for high-frequency trading (HFT), addressing the limitations of existing LLM-based financial systems that rely on slow, text-driven inputs. The framework decomposes the trading process into four specialized agents—IndicatorAgent, PatternAgent, TrendAgent, and RiskAgent—each operating on structured OHLC price data. IndicatorAgent extracts compact technical signals (RSI, MACD, etc.), PatternAgent uses multimodal reasoning to detect chart patterns, TrendAgent identifies directional bias via slope-aware trend detection, and RiskAgent integrates all signals into a risk-reward framework with fixed stop-loss and LLM-predicted take-profit levels. The system is built on LangGraph and generates traceable, natural-language rationales for each trade decision.
Extensive experiments across nine financial instruments (including Bitcoin, Nasdaq futures, S&P 500, and VIX) at 1-hour and 4-hour intervals demonstrate that QuantAgent consistently outperforms random, linear regression, and XGBoost baselines in both directional accuracy and risk-adjusted returns. Notably, it achieves up to 80% directional accuracy in a case study on SPX and shows robust risk control, with the best or near-best maximum and minimum returns across most assets. The multi-agent structure enhances interpretability and robustness through cross-agent validation, making QuantAgent a scalable and transparent solution for real-time, data-efficient HFT systems. Limitations include reduced accuracy on ultra-short timeframes (1-15 minutes) and latency issues, suggesting future work on streamlining tool orchestration and edge deployment.
Highlights
- 1First multi-agent LLM framework designed specifically for high-frequency trading (HFT) operating solely on OHLC price data.
- 2Decomposes trading into four specialized agents: IndicatorAgent, PatternAgent, TrendAgent, and RiskAgent, enabling modular and interpretable decision-making.
- 3Consistently outperforms baselines (random, linear regression, XGBoost) across 9 financial instruments at 1-hour and 4-hour intervals, achieving up to 80% directional accuracy.
- 4Provides traceable, natural-language rationales for trading decisions, enhancing interpretability compared to traditional black-box models.
- 5Demonstrates robust risk control with fixed stop-loss and LLM-predicted take-profit levels, balancing profitability and downside protection.
Methods
- MMulti-agent LLM framework built on LangGraph, with four specialized agents: IndicatorAgent (technical indicators), PatternAgent (chart pattern recognition via multimodal reasoning), TrendAgent (slope-aware trend detection using OLS), and RiskAgent (risk-reward integration).
- MIndicatorAgent uses five technical indicators: RSI, MACD, RoC, STOCH, and WILLR to extract compact signals from OHLC data.
- MPatternAgent generates simplified candlestick charts and compares current market structure to a library of chart patterns using LLM-based reasoning.
- MTrendAgent fits support and resistance lines via OLS regression and classifies trends (uptrend, downtrend, sideways) based on average slope and geometric relationships.
Results
- RQuantAgent achieves the highest directional accuracy in 8 out of 8 evaluated markets (e.g., 55.3% on NQ, 63.7% on SPX) at 4-hour intervals, outperforming all baselines.
- RBest risk-adjusted returns (R_cc) in 7 out of 8 assets, with positive returns on BTC (0.089), VIX (0.458), and SPX (0.341).
- RHighest maximum return (R_max) in 6 out of 8 markets, indicating effective capture of upside potential under risk constraints.
- RConsistent performance at 1-hour intervals, with pronounced gains in SPX, QQQ, and BTC, and robust generalization across asset classes.
- RCase study on SPX shows 80% directional accuracy over 10 overlapping windows, with correct identification of support bounces and momentum shifts.
